If you want to create your own 12 Days of Christmas Books tradition, it isn't too late to get started.
Traditionally the 12 Twelve Days of Christmas begin on Christmas Day and last until the beginning of Epiphany (January 6th; the 12 days count from December 25th until January 5th).

This one is new to our library this year. By the same author of God Gave us You, the little polar bear learns the answers to some very important questions, like 'Is God more important than Santa?' and 'Who invented Christmas?'

My Very favorite Christmas book to read with my children. The woman who touched thousands of children with Goodnight Moon and The Big Red Barn does the same thing for this classic beautiful story.
The Stable Where Jesus Was Born
A sing-song repeating rhyming story of the stable where Jesus was born and the animals that were present. Very sweet story for younger children.
A very funny parody of the Night Before Christmas featuring some amoo-sing cows {Sorry I couldn't help myself there!)
Another beautifully illustrated book with a sweetly told story of Santa's preparations.

So fun to read your post today…we just picked up "The Nutcracker and the Mouse King" at the bookstore and I just pulled out a copy of "The Best Christmas Pageant Ever" from my childhood. Yay! Your post has made me excited to read them with the kids.
And…since you've got such great taste, I will have to try a couple of the other books you've suggested
